When designing Retrieval-Augmented Generation (RAG) context engines for large-scale codebases, selecting which files to load into the LLM context window determines the success of code synthesis.

If we rely solely on semantic vector similarity (cosine distance of query against file chunks), we risk retrieving deep, specific helper files while completely missing the central coordinator modules (such as routing classes or interface orchestrators) that bind them together. Conversely, relying only on graph structures retrieves popular modules but misses the semantic intent of the query.

To select the optimal context, modern platforms implement Hybrid Retrieval: Vector Cosine + Graph Centrality Ranking.

By combining semantic vector scores with graph topological centrality metrics—like PageRank and Degree Centrality—retrievers rank files based on both relevance to the query and structural importance within the system.

This article details how to build a hybrid reranking engine.

Hybrid Context Reranking Architecture

The hybrid retrieval engine merges vector similarity ranks with graph centrality topological ranks:

graph TD A[User / Agent Query] --> B[Initial Retriever Phase] subgraph SG1_DualRankingEngine ["Dual Ranking Engine"] B -->|Dense Embedding Match| C[Rank List A: Vector Cosine Similarity] B -->|Graph Topology Analysis| D[Rank List B: PageRank & Closeness Centrality] end C --> E[Reciprocal Rank Fusion RRF Scoring Node] D --> E E -->|Hybrid Ranked Context List| F[LLM Context Window Ingestion]

Centrality Metrics in Software Architecture

  • Degree Centrality: Measures how many immediate connections (calls or imports) a node has. A method called by 50 different helper functions has high in-degree centrality and is a critical interface.
  • PageRank (Structural Importance): Measures the transitive importance of a file. A file imported by other important files gets a higher PageRank.
  • Closeness Centrality: Measures how close a node is to all other nodes in the network on average. High closeness nodes are excellent entry points for tracing system-wide behaviors.

Python Implementation: Hybrid Reranker with PageRank

Here is a production Python implementation of a Hybrid Code Retriever. It computes semantic vector similarity and PageRank centrality scores, and applies Reciprocal Rank Fusion (RRF) to output the final ranked context list:

import numpy as np
from typing import Dict, List, Tuple
from pydantic import BaseModel

class CodeEntitySpec(BaseModel):
    filepath: str
    cosine_score: float
    page_rank_score: float

class HybridReranker:
    """
    Reranks retrieved codebase files using Reciprocal Rank Fusion (RRF)
    on semantic vector similarity and PageRank centrality scores.
    """
    def __init__(self, k_constant: int = 60):
        # k is a smoothing constant for RRF scoring
        self.k = k_constant

    def compute_rrf(self, vector_results: List[str], graph_results: List[str]) -> List[Tuple[str, float]]:
        """
        Applies Reciprocal Rank Fusion (RRF) algorithm:
        RRF_Score(d) = sum(1 / (k + rank_i(d)))
        """
        rrf_scores: Dict[str, float] = {}

        # 1. Add ranks from semantic vector results
        for rank, doc_id in enumerate(vector_results):
            rrf_scores[doc_id] = rrf_scores.get(doc_id, 0.0) + 1.0 / (self.k + (rank + 1))

        # 2. Add ranks from topological graph centrality results
        for rank, doc_id in enumerate(graph_results):
            rrf_scores[doc_id] = rrf_scores.get(doc_id, 0.0) + 1.0 / (self.k + (rank + 1))

        # Sort documents by total RRF score in descending order
        sorted_docs = sorted(rrf_scores.items(), key=lambda x: x[1], reverse=True)
        return sorted_docs

class CodePageRankCalculator:
    """

    """
    @staticmethod
    def compute_pagerank(adj_matrix: np.ndarray, doc_ids: List[str], d: float = 0.85, max_iter: int = 20) -> Dict[str, float]:

        for _ in range(max_iter):
            # PageRank update equation: d * M * v + (1 - d)/N
            pagerank = d * np.dot(transition_matrix, pagerank) + (1.0 - d) / n

        return {doc_ids[i]: float(pagerank[i]) for i in range(n)}

Important Hybrid Retrieval Guardrails

When configuring hybrid context retrievers:

Important

Use Reciprocal Rank Fusion (RRF) for Rank Merging: Avoid multiplying or adding raw cosine similarity values directly to PageRank scores. They exist in completely different numerical scales. Using RRF normalizes scores by relative rank order, ensuring unbiased, robust merging.

Caution

Handle Dangling Graph Nodes: Codebases contain many leaf functions (dangling nodes) with zero outbound calls. Ensure your PageRank algorithm redistributes sink probability evenly across all nodes in the transition matrix to avoid sink leakage.

Real-World Enterprise Impact

Teams adopting Hybrid Vector-Centrality Retrieval report:

  • Perfect Architectural Context Selection: Retrievers consistently locate and include critical system-wide routing configurations alongside code snippet matches.
  • 45% Drop in Agent Refactoring Failures: Providing the LLM with both local snippet semantics and global import paths eliminates broken references during codebase updates.
